This month's speaker is Luigi Acerbi, Assistant Professor at the Department of Computer Science of the University of Helsinki, where he leads the Machine and Human Intelligence research group. He is a member of the Finnish Center for Artificial Intelligence (FCAI), an affiliate researcher of the International Brain Laboratory, and an off-site visiting scholar at New York University.

Title:

Practical sample-efficient Bayesian inference for models with and without likelihoods

Abstract:
Bayesian inference in applied fields of science and engineering can be challenging because in the best-case scenario the likelihood is a black-box (e.g., mildly-to-very expensive, no gradients) and more often than not it is not even available, with the researcher being only able to simulate data from the model. In this talk, I review a recent sample-efficient framework for approximate Bayesian inference, Variational Bayesian Monte Carlo (VBMC), which uses only a limited number of potentially noisy log-likelihood evaluations. VBMC produces both a nonparametric approximation of the posterior distribution and an approximate lower bound of the model evidence, useful for model selection. VBMC combines well with a technique we (re)introduced, inverse binomial sampling (IBS), that obtains unbiased and normally-distributed estimates of the log-likelihood via simulation. VBMC has been tested on many real problems (up to 10 dimensions) from computational and cognitive neuroscience, with and without likelihoods. Our method performed consistently well in reconstructing the ground-truth posterior and model evidence with a limited budget of evaluations, showing promise as a general tool for black-box, sample-efficient approximate inference — with exciting potential extensions to more complex cases.

Saad Kahn (Kelly Lab, EInstein) will introduce a topic that we haven't touched upon yet, namely Reinforcement Learning (RL). Saad will explain how RL works, and will present some relevant applications.

You can find a review of RL in biological systems (here) that also integrates ideas from neuroscience into artificial RL. Also, here is a general overview of RL.

Ruben Coen-Cagli will discuss a string of publications that demonstrate the use of deep generative networks in closed-loop neurophysiology experiments to drive neural populations towards pre-determined activity states. The method provides new insights into neural coding of visual inputs, and could be generalized to control and explore internal representations of any system whose inputs can be captured by a generative model. Memming Park from Stony Brook University will present his lab's recent work on machine learning for multi-scale interpretable modeling of neural dynamics.

Title: Learning structured neural dynamics from single-trial population recordings

Abstract: To understand the complex nonlinear dynamics of neural circuits, we fit a structured state-space model to noisy high-dimensional neural time series. We consider a multi-scale hierarchical generative model for the state-space dynamics to provide human understanding of complex dynamics as hierarchical composition of locally linear dynamical systems. We use Bayesian inference methods and an initialization strategy for both the posterior state trajectory and the posterior dynamics. The expressive power and interpretability of the inferred dynamics are evaluated for neural computation systems.

Ruben Coen-Cagli will discuss a novel algorithm for probabilistic segmentation of ambiguous images, with example applications to detect lung abnormalities in CT scans and to segment cityscape images. The algorithm combines two major recent breakthroughs in supervised learning (U-Net for biomedical image segmentation) and in unsupervised learning (Variational Auto Encoder).

Adrian Jacobo from the Rockefeller University will present an application of deep learning to enhance fluorescence microscopy of live tissue, described in this Nature Methods article.

Abstract: Imaging of live biological specimens using modern microscopy techniques has revolutionized our understanding of cellular and developmental processes. Nevertheless, the high intensity of light used in these procedures often has a negative impact on the samples, producing light induced toxicity or other undesired effects. I will show how to use deep learning to achieve content-aware image restoration and circumvent or mitigate some of these problems. I will give examples the application of this technique to the zebrafish lateral line.

Ruben Coen-Cagli will discuss generative adversarial networks, a technique that can produce synthetic data that look realistic (e.g. images or speech snippets) and can deceive high-performing deep networks. He will focus on a new extension that can deceive deep convolutional networks and human observers in the visual domain.
